SpecPilot agent boosts speculative decoding from 4.46× to 10.87×, no retraining

The SpecPilot paper introduces an autonomous agentic loop that discovers algorithm and systems optimizations for speculative decoding per deployment. Targeting three bottlenecks of existing parallel-drafting systems — few tokens accepted per step while reading all weights, verification work nearly halving speedup under batching, and deployment-specific tuning — SpecPilot uses a cost model to locate gaps to the ceiling, parallel agents to explore directions, token forcing against stock outputs to detect reward hacking, and structured memory to carry validated mechanisms forward.
Key results
- Autonomously discovered a general lossless 12-bit weight format, tree verification for hybrid recurrent targets, two-level verification, and three batching mechanisms
- Evaluated across 4 target models, 3 drafters, 2 GPU platforms, 5 benchmarks
- No training, no quality loss: speedup over autoregressive decoding raised from stock's 4.46× to 10.87× single-request, and 1.94× to 3.93× with batching
