Repeated-Data Pretraining Study Finds Smaller Batches Save GPU-Time Under Fixed Deadlines
jasondeanlee · x · 2026-10-15
An arXiv paper studies pretraining when compute is abundant but unique data is finite, requiring repeated training on the same data. Key findings:
- Validation loss vs. batch size is U-shaped: optimal batches are smaller than typical, as small-batch gradient noise acts as implicit regularization
- Single-pass training recipes can be retuned for multi-epoch training: repacking documents each epoch, weight tying, and positive embedding weight decay
- GPUs and time should be treated as separate resources: tighter deadlines favor larger batches, and latency-oriented parallelism can trade GPUs for shorter wall-clock training
- Counterintuitively, under a fixed time budget, smaller batches with fewer GPUs can beat larger batches with more GPUs on validation loss, challenging the practice of maximizing data parallelism under deadlines
