Study Reveals Non-Chronological Reasoning in DiffusionGemma

This paper investigates the transparency of diffusion LLMs like DiffusionGemma, decomposing it into variable and algorithmic transparency. While DiffusionGemma initially seems opaque due to continuous latent space operations, mapping information flow through an interpretable token bottleneck reduces its opaque serial depth to just 1.1x that of autoregressive Gemma 4. The study uncovers novel diffusion-specific phenomena such as non-chronological reasoning, token and sequence smearing, and intermediate-context reasoning. However, algorithmic transparency remains more challenging for diffusion models since all canvas tokens can change at every denoising step.
